[TRTLLM-17229][feat] Extend the mixed-precision KV cache to speculative decoding and the sparse MLA backends - #21021
PR #20452 added the First-N/Last-N mixed-precision KV cache for the standard KVCacheManagerV2: every full-attention layer stores its history in NVFP4,
the first mixed_precision_first_n and last mixed_precision_last_n tokens
stay in the attention dtype in a retained-token twin layer, and attention runs
on a staging copy. It rejected speculative decoding, the hybrid Mamba manager
and every sparse-attention backend. This PR lifts those three limits.
Speculative decoding (MTP, NGram, Eagle one-model). Draft layers keep a
plain cache in the retained dtype, on a separate draft manager or appended to
the target manager. With the overlap scheduler the engine corrects the KV
lengths on the device once the previous step's accepted draft tokens are
known; the staging gather and writeback now take the same correction in both
attention backends, and the staging view is hidden from draft layers that run
on another manager through the same metadata. Dynamic-tree drafting stays
rejected: it relocates accepted KV rows inside the pools after verification,
and the twin would not follow.
Hybrid Mamba manager (Qwen3.5, Kimi-K3). A manager class opts in with _supports_mixed_precision_kv; the hybrid manager appends the retained-token
layer group after its recurrent-state and attention layers and keeps the new
layer ids out of its Mamba layer mask. No kernel changes: these models use the
existing staging path.
Sparse MLA backends (GLM-5.2 DSA, DeepSeek-V4). These backends keep their
history in a native NVFP4 pool and already dequantize the rows their top-k
selected into an FP8 scratch before attention, so they get no staging copy.
The manager keeps the NVFP4 pool as the low-precision pool and appends the
retained-token twin in the high-precision dtype next to it (one twin per
compressed-history layer on DeepSeek-V4, keyed by compression ratio).
Write side: the DSA append and generation RoPE paths store each new row in
the twin through a small Triton row-store kernel driven by the twin's page
table; the DeepSeek-V4 compressor writes the twin with a second call of the
native compressor_postprocess_scatter, with the twin's page table and a
row mask that excludes pages the twin does not hold.
Read side: after the backend's gather, overlay_retained_rows copies the
twin's rows over the dequantized scratch rows of the retained tokens, so the
attention kernels and the NVFP4 path are unchanged.
Indexer caches are not touched. DeepSeek-V4.1 (CSA2) is not supported: its
pool format is natively NVFP4.
Public options are unchanged (kv_cache_config.dtype=mixed_nvfp4_<dtype>, mixed_precision_first_n, mixed_precision_last_n). The sparse-attention and
speculative-decoding rejections in validate_mixed_precision_kv are removed,
the KV cache doc lists the supported managers, and the retained-dtype unit
test's model-config stand-in gains the sparse_attention_config attribute the
loader now reads.
Follow-up (not in this PR): fold the overlay into the native NVFP4 gather
kernels so the read side needs no extra kernel.
Test Coverage
Unit tests: tests/unittest/_torch/attention/test_mixed_precision_backends.py
(speculative configs accepted except dynamic tree, one-model draft manager
keeps a plain dtype, staging lengths follow the device-side KV-length
correction on both backends, DeepSeek-V4 retained-row mask), tests/unittest/_torch/executor/kv_cache/test_mixed_precision_kv_cache.py
(appended draft layers stay native), tests/unittest/_torch/executor/kv_cache/test_mamba_cache_manager.py (hybrid
manager appends the retained group; page tables).
Dev Engineer Review
The change extends mixed-precision KV caching to supported speculative decoding, hybrid Mamba managers, and sparse MLA backends. Sparse backends retain selected rows in higher precision and overlay them on gathered NVFP4 history. Dynamic-tree drafting and DeepSeek-V4.1 (CSA2) remain unsupported.
Verify retained-row indexing, page-table mappings, dtype scaling, and sparse context and generation overlays. Also verify staging-length corrections, draft-layer dtype, and hybrid-manager layer placement. Test execution results were not supplied.
QA Engineer Review
Three test files changed:
test_mixed_precision_backends.py adds coverage for speculative configurations, draft-cache configuration, staging-length corrections, and retained-row behavior during sparse draft forwards.
test_mixed_precision_kv_cache.py adds test_appended_draft_layers_stay_native, which checks that appended draft layers retain their native dtype.
test_mamba_cache_manager.py adds test_v2_hybrid_mixed_precision_appends_retained_group, which checks retained-layer mapping, buffers, page-table entries, and cache validity.
test_mixed_precision_kv_cache.py is listed in tests/integration/test_lists/test-db/l0_b200.yml. The CI list includes a different test from test_mamba_cache_manager.py, not the added mixed-precision test. The backend test file is not listed in the inspected CI or manual-QA lists. test_mixed_precision_retained_dtype_must_match_model_dtype is marked SKIP in tests/integration/test_lists/waives.txt.
Coverage verdict: needs follow-up. The supplied test summary does not establish dedicated numerical coverage of sparse retained-row writes and overlays. Test execution results are unavailable.

Keep full history and First/Last storage in REQUIRED lifecycle groups. Reuse native matching, commits, offload and eviction without new C++ state or a separate replay policy. Materialize native KV directly from the paged high or low/scales pools and
quantize all new tokens directly back into low/scales and retained high pages.
Reuse FlashInfer block quantizers and CUTLASS conversion/copy primitives in
the kernel directory. Remove four copy kernels and six codec workspaces.
Attention dtype, quantization configuration, fusion, and FMHA dispatch stay
on the existing native path.
Validate 24 dtype/layout/stride/KV-factor cases with strict whole-pool byte
checks and CUDA Graph replays changing page tables and lengths. Six focused
source tests also pass through standalone kernel loading; the installed
native binding lacks PoolRebalanceConfig, so full backend tests are pending.
The FP8 codec matches FlashInfer's public CuTe quantizer. Compared with the
native CUDA quantizer, all observed differences are exact FP4 midpoints with
equal minimum quantization error caused by reciprocal evaluation order.
Keep the existing codec rather than introduce another rounding implementation.
FlashInfer PR 3387 is related precision work, not a confirmed fix for this case.

Validate position_ids before storing retained rows.
The DSA generation entry point accepts position_ids=None and forwards it to forward_absorption_generation. When mixed-precision retained rows are enabled, the fused path appends the cache rows and then calls store_retained_generation_rows. That helper asserts that position_ids is present. This can fail after the cache append.
Validate the requirement before mla_rope_generation, or derive the retained-row positions from generation metadata. Add a regression case in tests/unittest/_torch/attention/test_mixed_precision_backends.py.

Please double check this? On this path position_ids is never None: every DSA layer runs the indexer projection (pre_indexer_proj -> rotary_emb(position_ids, ...)) with the same tensor before attention, and the DSA/DSV4 models always pass it. The assert in store_retained_generation_rows documents that contract; a None would already fail in the indexer, so there is no state to protect and no reachable case for a regression test.
…rd on the sparse MLA backends
The speculative path swaps the draft manager into the metadata before a draft
forward. That manager has no twin layers, so filling the retained page table
there raised StopIteration (GLM-5.2 MTP, allhigh and mixed). Swap the table to
None for the draft forward like the other draft-specific fields, which also
turns has_mixed_precision_retained_rows off for every hook during the draft;
restore_draft_swaps() brings it back. The retained-pool helper keeps only the
check for draft layers appended to the target manager.

Add direct coverage for the retained-layer guard in _retained_kv_cache().
_retained_kv_cache() returns None for a draft or plain layer and returns the retained pool for a target layer. The inspected tests do not call this helper, so a wrong layer mapping could pass the current suite. Add a focused test to tests/unittest/_torch/attention/test_mixed_precision_backends.py that asserts both branches.
Without this test, a regression in layer_offsets or high_layers can select the wrong retained pool. Retained-row writes and overlays would then use that pool.

…arse and draft paths
- DeepSeek-V4 twin write: rows whose block lies past the retained page table
are treated as not held instead of reading the table's last column.
- Draft layers appended to a manager built from an explicit layer mask (the
combined hybrid speculative manager) stay on the plain cache: the boundary
now comes from the model's layer count.
- KVCacheManagerV2 asks the subclass whether its pool is natively NVFP4, so
DeepSeek-V4, which hands the base manager FP8 while compressing in NVFP4,
accepts every retained dtype.
- The loader keeps the retained-dtype check for sparse models whose pool maps
to NVFP4; TorchLlmArgs rejects sparse algorithms other than dsa and
deepseek_v4 before a manager is built.
- Tests: the mask test covers a released page and an out-of-range block, the
loader test a sparse model, a hybrid manager test an appended draft layer,
the validator test an unsupported sparse algorithm.
Signed-off-by: tianruih <tianruih@nvidia.com>
- DeepSeek-V4 overlays the retained rows once, after either gather branch.
- Drop the native-NVFP4-pool hook: the sparse MLA backends keep their
retained tokens in FP8, the dtype DeepSeek-V4 already hands the base
manager, so the retained-dtype check needs no override.
- Rename the staging predicate to _has_mixed_precision_staging: the sparse
backends run attention on the gather's FP8 scratch and answer False while
their manager does hold mixed-precision layers.
- Drop the DeepSeek-V4 metadata override that the DSA metadata already
provides, and an accidental blank-line change in the compressor.

…arse-managers-20261022
Main modularized the Mamba cache managers (NVIDIA#18843): the hybrid manager now
lives in kv_cache/mamba_cache_manager/mamba_cache_manager_v2.py. The three
hybrid hunks of this branch (mixed-precision opt-in, appended layer groups
in _is_local_mamba_layer, get_buffers keyword pass-through) and the two
hybrid tests are re-applied on the new layout; the old module is removed.
Signed-off-by: tianruih <tianruih@nvidia.com>
…d-precision opt-in
Main now builds one thin subclass of MambaHybridCacheManagerV2 per model
(NVIDIA#18843), and the opt-in check only looked at the concrete class, so
Qwen3.5 and Kimi-K3 rejected mixed_nvfp4_* after the merge. The check now
takes the nearest declaration in the class hierarchy; the base manager's
own declaration still covers only the plain dense manager, so sparse
subclasses that never opted in stay rejected. The GLM-5.3-Flash manager
(hybrid KDA + k-pool sparse MLA) opts out explicitly: its sparse MLA
backend has no retained-row hooks.
The fused DSA generation kernel writes only the NVFP4 pool; the FP8
retained twin is written by our own store, whose input still holds the
unrotated k_pe. The store kernel now applies the same RoPE itself, and
the torch rotation chain is gone.
Signed-off-by: tianruih <tianruih@nvidia.com>
The two hook comments now state that the native kernels write only the NVFP4 pool and the hooks write the FP8 twin.

With the rotation inside the Triton kernel, GLM-5.2 allhigh stopped
matching the plain FP8 cache on one prompt: Triton fuses x*cos - y*sin
into one FMA, the native append kernel's result corresponds to separate
roundings, and the one-ulp difference occasionally flips an FP8 value.
enable_fp_fusion=False restores the bit-exact match.

No pool is zeroed on creation, the plain FP8 pool included, and the twins are only read at rows that were written.

…ow-precision dtype
The two checks that recognised a native low-precision pool hard-coded NVFP4. They now compare with the low dtype named by the mixed-precision config, so a further low format needs no change here.
Signed-off-by: tianruih <tianruih@nvidia.com>
…pool
The base manager decided by dtype whether a manager's own pool already
holds the history in the low-precision format. The sparse MLA managers
now declare it (_mixed_precision_native_pool), the three checks read the
declaration, and the loader maps mixed_<low>_<high> on those backends to
the low format instead of hard-coding NVFP4.

…precision hooks
L0 build 66614 on e381bb8 failed in four test files that the branch's own
test set did not cover:
- deepseek_v4/test_compressor_module.py: the compressor's retained-row hook
reads metadata.has_mixed_precision_retained_rows; the test's metadata
stand-in now carries it (False).
- test_attention_mla.py: the _Prefixes stand-in binds on_update_kv_lens,
which also reads the mixed-precision staging view; the stand-in now has it.
- sharing/test_public_surface.py: the manager must not expose names about
lending (lend|lent|sharing|staging|retain); fill_retained_page_table is
renamed fill_high_precision_page_table, matching the low/high naming of
fill_mixed_precision_page_tables.
- test_mamba_cache_manager.py: the draft-layer boundary is computed only when
mixed precision is on, so a plain spec-config stand-in is never asked for
its decoding mode.

Sparse MLA backends (GLM-5.2 DSA, DeepSeek-V4). These backends keep their

tests/unittest/_torch/attention/test_mixed_precision_backends.py— Covers speculative configuration, draft-cache behavior, retained-row draft masking, and staging-length updates. It is absent from the inspected CI and manual-QA lists; one test is marked skipped inwaives.txt.tests/unittest/_torch/executor/kv_cache/test_mixed_precision_kv_cache.py— Checks appended draft-layer dtype and mixed-precision cache behavior. The file is listed intests/integration/test_lists/test-db/l0_b200.yml.tests/unittest/_torch/executor/kv_cache/test_mamba_cache_manager.py— Checks hybrid-manager retained-layer mapping, buffers, page table, and cache validity. The inspected CI list includes a different test from this file, not the added mixed-precision test.
