[TRTLLM-17384][feat] Support shared-prefix attention for n-sample requests in FMHA - #20841
The patch adds an opt-in sampling_shared_prefix FMHA library for n-sample requests. It adds Triton kernels for prefix/tail attention, KV writes, RoPE, and attention-state merging. It also adds planner integration, FMHA cache-key separation, and CUDA graph attention variants.
The patch also changes Qwen2’s base class, sampler staging and seed assignment, executor response handling, KV-cache logging, and scheduler checks. These changes extend beyond shared-prefix attention and need separate compatibility and regression validation. The supplied evidence does not include test results. Correctness, API compatibility, and performance remain unverified.
QA Engineer Review
The patch adds tests for FMHA registry behavior, executor response handling, sampler staging, seed assignment, Qwen2 EAGLE-3, shared-prefix RoPE, and shared-prefix FMHA. Coverage includes dense-reference attention math, planning and grouping, cache writes, CUDA graph replay, speculative decoding, and opt-in behavior.
The shared-prefix test changes include a reduction to representative cases, including a Curiosity-shaped q_len=9 case, a GQA case, and a page-crossing case. The supplied commit summary also reports that end-to-end shared-prefix tests run only with CUDA graphs, and that several speculative and workspace-related tests and helpers were removed. Current test-list evidence shows test_torch_sampler.py and test_in_graph_sampling.py in tests/integration/test_lists/test-db/l0_a10.yml. No matching entries were found for the other changed test files in the searched lists. No test results are provided. Coverage verdict: needs follow-up.

…earch
Decode attention for wide beams (e.g. 256) falls back to the legacy MMHA
kernel, which re-reads the prompt KV once per (beam, head); XQA rejects
beam widths where head_grp_size * beam_width > 32. Add the
beam_shared_prefix FMHA library (TLLM_FMHA_LIBS=+beam_shared_prefix,
off by default): generation-only beam-search batches run FlashInfer
paged prefill over the shared prompt once per request, attend to the
indirection-gathered generated tail with torch ops, and merge the two
states through their base-2 log-sum-exp. RoPE must be pre-applied by the
model (e.g. Qwen3). TLLM_BEAM_SHARED_PREFIX_MAX_TAIL caps the tail length
under CUDA graphs; TLLM_BEAM_SHARED_PREFIX_CHECK=1 synchronizes per stage
and validates the page table and the prefix attention against dense
references. The per-step host plan runs from TrtllmAttentionMetadata.prepare
so it precedes both CUDA-graph capture and replay.

Plain n-sampling (beam_width == 1) turns one request into a parent plus
n - 1 child requests that map the same prompt pages when KV-cache block reuse
lets them share the parent's blocks. Group the generation rows of a batch by
their common leading full pages and attend per step in two parts that are
merged through their base-2 log-sum-exp:
* prefix: one FlashInfer paged-prefill call over each group's shared pages,
the group's queries stacked as the Q tile;
* tail: one FlashInfer paged-decode call over each row's own remaining pages
(partial prompt block, generated tokens and the current token).
The page tables come from the V1 block-offset table or from the V2 manager's
slot-indexed table. The partial results are written in fp16 for bf16 models so
the merged result carries the rounding error of a single bf16 rounding.
TLLM_BEAM_SHARED_PREFIX_CHECK=1 compares sampled rows with a dense fp32
reference.
CUDA graphs: the whole per-layer path (K/V write and query gather, prefix
call, tail call, merge and output scatter) runs inside the decode graphs.
Fused Triton kernels do the gather/write and the merge/scatter, FlashInfer
wrappers use their CUDA-graph mode with buffers sized per captured batch size,
and the write slots and tail lengths are derived on the device from the
runtime KV lengths, so a step re-plans only when the grouping or a page
boundary changes. The per-layer KV-pool view cache now rebinds when the KV
manager changes after memory estimation.
Size gate: the library is used only when at least half the rows share a
prefix, groups have at least 4 rows and the shared prefix is at least 5000
tokens per row (TLLM_BEAM_SHARED_PREFIX_MIN_SHARED_TOKENS and
TLLM_BEAM_SHARED_PREFIX_MIN_GROUP override). The decision is part of the CUDA
graph key (attn_variant), so each captured batch size holds a library graph
and a regular-kernel graph.
The library is ordered ahead of flashinfer_trtllm_gen so it is consulted for
generation batches on Blackwell, the FMHA selection cache key includes whether
the batch has a shared-prefix plan, and the beam-search path stays limited to
the V1 manager whose page layout it was written for.

n-sample children carry seeds, so _SeedManager.take_row_seeds ran a per-row
Python loop with torch scalar indexing every step (about 0.7 ms at 160 rows).
Use numpy views of the seed/offset tensors, vectorise the one-row-per-slot
case and send seeds and offsets in one host-to-device copy.
KVCacheManagerV2._log_window_crossing called logger.is_debug_enabled(), which
walks the call stack, for every generation request every step. Test whether a
windowed layer group is crossed first.

… speculative decoding
Let the n-sample shared-prefix library serve target-model batches whose
generation rows carry 1 + K tokens (draft tokens verified together).
The prefix call stacks the q_len queries of each sharing group against the
shared pages. The tail is a causal FlashInfer prefill with q_len queries per
row over the row's own pages. K/V of the step's tokens are written at
positions derived from the device KV lengths: under the overlap scheduler
the host lengths may exceed the true ones by up to the draft length, so the
host page tables only bound the work and the last-page lengths are derived
on the device (zero or negative values are fine, FlashInfer adds them to
(pages - 1) * page_size in unsigned arithmetic).
The draft layers of one-model speculative decoding run on the same metadata
with the draft KV manager swapped in; the library declines them by comparing
the manager with the one the plan was built for.

…es; fix beam-search e2e test
Add an e2e test that runs greedy n-sample requests (prompts of 511/512/513
tokens, eager and CUDA graph) with and without the library and requires any
token divergence to sit where the regular kernel's top-2 logprob gap is at
most 0.25 nats (two bf16 steps of the logits). Drop the logprobs request from
the beam-search e2e test, which the LLM API now rejects.

The library is faster in GPU time in a decode window (nsys, P8000 n20:
7.55 vs 7.98 ms/step early, 9.13 vs 8.53 ms/step after 300 steps, when the

P8000 n80 1.65x, P4000 n40 1.13x), and EAGLE-3 itself is slower than no
speculation for these batches at temperature 1 (e.g. P8000 n20 6.9k vs 11.5k
tokens/s, P1600 n80 10.6k vs 32.0k), mean accepted length 1.2-2.7.
Add TLLM_BEAM_SHARED_PREFIX_SPEC_MIN_SHARED_TOKENS (default off) as the gate
for batches with draft tokens; the graph variant and the eager gate use it.

…one Triton kernel
Under CUDA graphs the n-sample path ran six kernels per layer (K/V write and
query gather, FlashInfer prefix prefill, FlashInfer tail decode, two merges,
scatter) and re-planned FlashInfer wrappers on the host. A single Triton launch
now does the group-stacked prefix attention (split over the shared pages, the
group rows times the GQA factor as the tensor-core M dimension), the per-row
tail attention with the current token taken from the QKV tensor and persisted
in its page, and a second small launch merges the split states. The grids are
fixed and all sizes come from device tensors, so it is graph capturable; group
tables live in fixed device buffers refreshed when the grouping changes.
TLLM_BEAM_SHARED_PREFIX_FUSED=0 selects the FlashInfer path.

…curacy floor
Cover a group wider than one kernel program (70 rows), a placeholder row, MHA
and GQA head layouts and two prefix split counts: the output error against
float64 must stay within 10% of plain bf16 SDPA, and no cache slot other than
the written ones may change.

…t without __init__
_log_window_crossing read _windowed_layer_group_sizes before the debug-level
check, which broke tests that build a KVCacheManagerV2 without running
__init__. Resolve the debug-level answer once per manager (it walks the call
stack) and look at the window sizes only when debug logging is on.

…ache manager
The n-sample (beam_width == 1) path now requires KV cache manager V2
(use_kv_cache_manager_v2=True, the default). Batches served by another
manager are declined and run the regular kernel. The V1 page-layout and
table-row branches, the V1 cache-key code and the V1 test fakes and
parametrisations of the sampling path are removed. The beam-search path
keeps its V1 helpers.

…rary
The library now serves n-sample requests only (beam_width == 1, KV cache
manager V2). Remove the beam-search planner and per-step state, the
cache_indirection tail gather, the beam page-table logic and the beam-only
tests. A batch with beam_width > 1 is declined and runs the regular kernel.
The library, class and environment variable names keep their beam_shared_prefix
spelling.

…library
Models such as Qwen2 hand pos_embd_params to the attention backend, which then
applies RoPE inside the attention op on the raw QKV. The library used to decline
them. It now rotates the Q and K heads of the packed QKV in place (one small
Triton launch per layer) from the op's own cos/sin table at the device position
kv_len - q_len + j, before the K/V write, so the rest of the path is unchanged
and CUDA graph capture stays free of host reads. NeoX rotation with no or linear
scaling is supported; yarn, llama3, dynamic, long-rope, mRoPE and GPT-J styles
are declined and take the regular kernel.

Three per-request costs that do nothing in the common case:
- Non-streaming requests produce no result until they finish
(LlmRequest::createResult), yet create_response ran for every request
on every step. Skip it unless the request is finished, streaming, or
returns perf metrics (those keep the call, which finalizes ctx GPU totals).
- _is_preemption_pending (two calls and a dict lookup per request) only
matters while a victim is parked; ask the manager once per pass.
- perf_manager.append_step_metrics returns at once while metrics are off;
do not call it then.
At 160 rows _handle_responses drops from 0.31 to 0.21 ms per step.

TorchSampler._can_use_fast_path re-evaluated, for every request on every step,
checks that depend only on parameters fixed at admission (sampling mode,
top-p decay, logprobs, penalties, bans, bias, min length). Keep the verdict on
the request (py_fast_path_ok) and read it back, so a batch costs one attribute
read per row. resolve_in_graph_sample_type also collapses its three scans of
the batch (draft length, dummies, dummy ordering) into one.
With in-graph sampling on, 160 rows: tier resolution in the graph-key build
drops from 0.23 to 0.09 ms per step.

…mpling
stage_in_graph_sampling rebuilt the destination indices, the per-row
temperature/top-k/top-p/min-p params and the seed bookkeeping on every
step, and each of those is a pinned host tensor, a host-to-device copy and a
couple of index_select/copy_ launches. In a steady decode batch the requests
and slots are the same as the previous step, so none of it has changed (a slot
gets new params only when a new request is admitted to it) and the persistent
buffers still hold it. Remember the staged batch (tier, request ids, slots)
and, when it repeats, write only the Philox seeds/offsets, which advance every
step. Staging the params directly, or a different batch, drops the memo.
With in-graph sampling on, 160 rows: staging drops from 0.41 to 0.20 ms per
step.

_SeedManager.take_row_seeds spent its time on bookkeeping that only matters when
unseeded rows share the batch. For a batch of unique slots whose requests are
all seeded (n-sample children), take the slots' seeds and offsets directly and
bump the offsets, skipping the np.where, unseeded mask and arange; and check slot
uniqueness with a set instead of a sort. The pinned staging copy goes through
maybe_pin_memory as the pinned-memory policy hook requires.

After the forward, _process_requests rebuilt for every step what staging had
already worked out for the same rows: the live-request list, a pinned int32 slot
tensor that only the finish-reason path reads, and a per-request check
(_request_needs_finish_reason_kernel) that is fixed for a request's lifetime.
Record those in a _StagedBatch next to the staging memo; when the batch handed
to the sampler is exactly the staged rows, use them. Any other batch (for
example the engine dropped padding) keeps the previous path.
With in-graph sampling on, 160 rows: sample_async drops from 0.31 to 0.22 ms per
step.

…raft-location scan
Two loops that run once per request every decode step did work that is almost
never needed:
- The V2 scheduler walked every request to pre-claim PEFT pages even with no
PEFT cache manager (pre_claim_peft returns at once then), and tested four
conditions per request to find an exclusive remote-tail context request even
during pure decode. Skip the PEFT walk when there is no PEFT manager, and test
the context-init state first so a decode request fails it in one compare.
- _update_kv_cache_draft_token_location read the request state (a native enum
property) before the accepted-token count, which is zero on almost every
step. Test the count first.
Small: at 160 rows the V2 scheduler goes from 0.66 to 0.64 ms per step.

… Nsight kernel times
The library with draft tokens is used when the shared prompt per row exceeds the
break-even of the regular multi-token kernel (re-reading the shared pages per row)
against the fused kernel (tensor-core work per query), from head layout and q_len.
The env threshold still overrides. Add a split-launch option to the fused kernel
(off by default: slower in measurement).

…ile time in single-purpose launches
The prefix launch and the tail launch of the two-stream path called the same kernel with a runtime
`pid < num_prefix_programs` test, so both bodies were compiled into each launch and a launch paid
the registers and shared memory of the heavier one (the prefix tile) even when it ran tail programs
only. MODE 1 (prefix only) and MODE 2 (tail only) now select their body with the constexpr, so each
launch is sized for its own work.
Effect (GB200, MHA 20/20 d128, q_len 9, 3 groups x 40 rows, 4000-token prompts, 1000-token tails,
per layer, CUDA graph): with the 64-row prefix tile 371 -> 364 us (small); the point is that it
makes larger prefix tiles usable: a 128-row tile in the old arrangement took 2.07 ms (the tail
programs inherited its footprint) and 326 us after this change; the tile default follows.

…TRTLLM-Gen context kernel on SM100
The Triton prefix tile reaches 265-330 TFLOP/s (255 registers, 142 spills; a warp-specialized dense Triton
probe reaches ~500 and needs contiguous pages). FlashInfer exposes the TRTLLM-Gen context kernel from Python
with a paged HND KV cache, causal=False and return_lse, so no C++ change is needed: every sharing group is a
request whose KV is its page list and whose queries are the group's rows (grouped order, q_len tokens each).
It runs ~700 TFLOP/s (3 groups x 40 rows x q_len 9, 4000 shared tokens: 63 us against 134 us).
* CtxPrefix: fixed-address request tables (block table, KV lengths, cumulative lengths) rewritten only when the
groups change (prefix version); groups are cut into requests of at most 504 query tokens because the kernel's
tile choice depends on max_q_len (63 us up to 512 queries, 112 us above) and max_q_len is a launch constant of
the captured graph, so a larger group in a later batch stays correct.
* A gather kernel puts the queries in grouped order (the rows of a group are not contiguous in batch order); a
merge kernel combines the kernel's (normalized output, base-2 LSE) with the Triton tail states and scatters to
batch order. Placeholder rows are masked, empty padding groups cost nothing (measured).
* The tail launch runs alone: one split, 128-token tiles, 4 warps (192 us at 120 rows x 1000 tokens, 6.4 TB/s).
* TLLM_BEAM_SHARED_PREFIX_PREFIX_KERNEL=triton keeps the Triton prefix; other devices (SM90...) and dtypes take it
automatically.
Per layer (GB200, MHA 20/20 d128, q_len 9, 3 groups x 40 rows, 1000-token tails, CUDA graph), TRTLLM-Gen decode /
Triton prefix / context prefix: 600 prompt tokens 254 / 233 / 226 us; 1600: 301 / 255 / 235; 4000: 480 / 314 / 266.

…st page table ahead of the device length
Flat random attention over ~1000 keys hides a wrong tail length under the tolerance. The new case makes the
newest cached key and the first step token carry the weight (large query, aligned keys) with the host table a
page ahead (tail last-page length <= 0), page-boundary tails, shuffled rows, placeholder rows, q_len 2..9, MHA and
GQA. Dropping the newest cached token from the kernel's tail length fails all 16 cases (checked).

…kernel prefix and the single-purpose launches
Per-layer microbenchmark (GB200, MHA 20/20 d128, q_len 9, CUDA graph, 45 cells: 3x40, 6x20, 1x40 rows, 150-4000
prompt tokens, 300-1800 tail tokens) fitted as a + b*R*P + c*R*T over R rows, P shared and T tail tokens:
TRTLLM-Gen decode 5.35e-4 R P + 1.43e-3 R T + 39.5 us, Triton prefix 2.61e-4 R P + 1.40e-3 R T + 44.0, context
kernel prefix 1.61e-4 R P + 1.42e-3 R T + 43.6 (rms residuals 19 / 17 / 11 us). The tail terms agree, so the
existing model structure holds with new constants (and a separate set for the context-kernel prefix): break-even
~100 shared tokens per row for MHA (was 2700 with the old kernel, a whole-generation A-B-B-A fit). The row-count
floor stays: one group of 40 rows measured 0.9-1.0x up to 1600 shared tokens. GQA with draft tokens keeps no model.

At q_len 1 a group is 40 queries (a small tile for the context kernel) and the Triton prefix is faster per layer
(207 vs 218 us at 1600 shared tokens, 228 vs 249 us at 4000; 3 groups x 40 rows, MHA 20/20, 1000-token tails);
at q_len 4 the context kernel is 1.02x / 1.06x faster, at q_len 9 1.08x / 1.18x.

…s of the model, not from the microbenchmark
The previous commit fitted lib_extra_us_per_row to the CUDA-graph microbenchmark, whose TRTLLM-Gen decode
baseline carries ~40 us per layer that the same kernel does not have in the model (183 us at 600 + 850
tokens in Nsight, 234 us in the microbenchmark) and which leaves out the rotary, gather and merge
kernels, so the gate opened at ~90 shared tokens and the default gate lost 5.7% at 600 tokens
(ABBA 27556 vs 29209 tok/s). Fitted to Nsight steps of the model instead (3 groups x 40 rows, tails ~850):
library minus regular GPU time per step +1.08 ms at 600 shared tokens, -7.0 ms at 4000 -> break-even ~1050
tokens, 0.39 us per row for the context-kernel prefix, 0.30 for the Triton prefix.

in its length (27 us per 1000 tokens between 600 and 1600, 51 between 1600 and 4000 per layer at 120 rows;
it is served from L2 until it no longer fits), and every group costs a fixed ~7 us per layer (3x40 vs 6x20
rows at equal bytes, microbenchmark). With the mean-length gate, mixed-length batches at mean 1100-1200
tokens lost 5.3% (4x32) and 6.7% (6x20) end to end. The saving is now summed over groups
(SPEC_GROUP_MODEL: -53.8 + 0.0446 P + 2.9e-6 P^2 per layer for 3x40 rows, solved from the three Nsight
points -26 / +25 / +171 us at 600 / 1600 / 4000 shared tokens, with the per-group cost split out) and the
library is used when it is positive. An explicit TLLM_BEAM_SHARED_PREFIX_SPEC_MIN_SHARED_TOKENS still wins.

… a massive-activation regression test
FlashInfer's FA2 kernels (the library's eager prefix/tail calls) initialize the running maximum to -5e4 and use
5e4 as infinity: for heads whose scaled logits are far below that (Qwen2.5-7B layer 27: -3500..-6800) they
return exactly zero. The fused Triton kernel and the TRTLLM-Gen context kernel do not: on the captured 7B layer-27
data (single row, q_len 1, 28 heads) no head is zero, the Triton output is within 1.35 bf16 floors of a float64
reference and the context-kernel prefix within ~1 ulp of the largest value (3.2 floors), and the context kernel's
base-2 LSE for heads 10/12/13 (-5659, -3589, -6843) matches the true value to 1e-3.
Eager batches now plan into the same fixed-address buffers as captured ones (re-created when the row count
changes) and take the fused kernel whenever it supports the shape, so FlashInfer is off the n-sample path on
every supported shape; the eager gate keeps the batch-level decision (now with the group profile).
test_fused_attention_with_massive_activations: keys ~600x, queries ~80x the normal scale, odd heads with every logit
hugely negative, float64 reference, Triton and context-kernel prefix, q_len 1/2/9, MHA and GQA 28/4.

Seed the random tensors of _fused_spec_case.
gen is a seeded CPU generator. It only drives cached and perm. The calls that build pool, q, k, v (and u in the peaked branch, line 1886) use the global CUDA random state. test_fused_spec_attention_matches_dense_and_writes_kv, test_fused_spec_attention_peaked_attention_host_ahead_of_device and test_fused_spec_attention_graph_replay_is_bit_exact do not seed that state. Their inputs therefore change with each run and with test order, and fixed tolerances such as 2e-2 can fail on a rare draw. Only test_fused_attention_with_massive_activations calls torch.manual_seed.

Do not let the acceptance check pass silently.
run returns None when no stat has numRequestsWithDraftTokens > 0. Line 2256 then skips the comparison. The test passes without checking the acceptance rate, which is the behavior its name and docstring promise. A stats-format change, or a run where speculation never engages, gives a false pass. Assert that both runs report draft-token requests before comparing.

…prefix to sampling_shared_prefix
The library no longer serves beam search: it only plans n-sample batches and
declines beam_width > 1. Rename it to match what it does:
- files beam_shared_prefix{,_fused,_kernels}.py -> sampling_shared_prefix*.py
and the two test files likewise
- library name beam_shared_prefix -> sampling_shared_prefix
(TLLM_FMHA_LIBS=+sampling_shared_prefix)
- BeamSharedPrefixFmha -> SamplingSharedPrefixFmha
- TLLM_BEAM_SHARED_PREFIX_* environment variables ->
TLLM_SAMPLING_SHARED_PREFIX_*
- drop the docstring note that the name is historical
The library was never released under the old names. Names that belong to the
KV cache manager (beam_width, max_beam_width) are unchanged.

Add a graph-selection test that uses one batch size first with a qualifying shared prefix and then without one. Assert that lookup selects distinct attn_variant keys and that each key uses matching graph metadata. When an eligible active plan becomes inactive, FmhaManager.select must select the regular library instead of reusing the cached shared-prefix selection. Add a test in tests/unittest/_torch/attention/test_fmha_manager.py that calls select for both states with identical shape and key inputs, then asserts the second selection.
The existing tests cover registry ordering and direct has_active_plan results, but not this cache transition. This is additional coverage for currently correct behavior, so classify it as a recommended refactor rather than a functional-correctness issue.

Restore a partial-RoPE case in the direct rope_qkv_inplace parameterized tests
by adding a case with head_dim 128 and rotary_dim 64, so the assertion checks
that dimensions beyond rotary_dim remain unchanged.
Exercise the open-gate path or narrow this test’s contract.
The two n=6 prompt groups have shared prefixes of 600 and 410 tokens. With TLLM_SAMPLING_SHARED_PREFIX_MIN_SHARED_TOKENS="100000", resolve_graph_variant selects the regular-kernel graph variant. The reference and candidate can therefore use the same attention path, so the token assertion can pass without checking shared-prefix output.
The test also enables only cuda_graph=True; its eager behavior is not covered. Add the open-gate case and remove the unsupported eager claim, or narrow the test name and docstring to the gated-off CUDA-graph fallback.

Dev Engineer Review
The patch adds an opt-in
sampling_shared_prefixFMHA library for n-sample requests. It adds Triton kernels for prefix/tail attention, KV writes, RoPE, and attention-state merging. It also adds planner integration, FMHA cache-key separation, and CUDA graph attention variants. The patch also changes Qwen2’s base class, sampler staging and seed assignment, executor response handling, KV-cache logging, and scheduler checks. These changes extend beyond shared-prefix attention and need separate compatibility and regression validation. The supplied evidence does not include test results. Correctness, API compatibility, and performance remain unverified.
QA Engineer Review
The patch adds tests for FMHA registry behavior, executor response handling, sampler staging, seed assignment, Qwen2 EAGLE-3, shared-prefix RoPE, and shared-prefix FMHA. Coverage includes dense-reference attention math, planning and grouping, cache writes, CUDA graph replay, speculative decoding, and opt-in behavior.
The shared-prefix test changes include a reduction to representative cases, including a Curiosity-shaped
q_len=9case, a GQA case, and a page-crossing case. The supplied commit summary also reports that end-to-end shared-prefix tests run only with CUDA graphs, and that several speculative and workspace-related tests and helpers were removed.
